KV cache quantization is an LLM inference optimization that stores the transformer’s attention key/value (KV) cache in lower precision (for example INT8 or INT4 instead of FP16/BF16) to reduce GPU memory usage and increase concurrent throughput—especially for long-context, high-concurrency serving.

What is KV Cache Quantization?

During autoregressive decoding, transformers keep past attention keys and values for each layer and token so they don’t need to be recomputed. This KV cache can become the dominant memory cost in serving.

KV cache quantization compresses these tensors by representing them with fewer bits. Implementations typically:

  • Quantize KV values per head, per channel, or per block with learned or calibrated scales.
  • Dequantize on-the-fly inside attention kernels (often fused) when computing attention.
  • Use mixed precision (e.g., weights in FP16, KV cache in INT8) to balance quality and speed.

The main trade-off is accuracy: aggressive quantization can introduce noise that slightly degrades generation quality, particularly for long sequences. Systems tune bit-width and scaling strategy to maintain acceptable quality while gaining capacity.

Where it’s used and why it matters

KV cache quantization is used in LLM serving engines to fit more active sessions per GPU and to support longer context windows without running out of memory. It matters for:

  • Chat systems with many concurrent users.
  • Agentic workflows that keep long tool traces in context.
  • Long-context models where KV cache scales linearly with sequence length.

Operationally, it reduces OOM failures and improves cost efficiency. It is often combined with paged attention, speculative decoding, and prompt caching.

Examples

  • Serving a 128K-context model with many concurrent conversations: quantizing KV from FP16 to INT8 can substantially increase concurrency.
  • Using INT4 KV cache for less critical layers while keeping sensitive layers in higher precision.

FAQs

1. Is KV cache quantization the same as model quantization?
No. Model quantization compresses weights and sometimes activations; KV cache quantization compresses the runtime attention cache.
2. Does it speed up inference?
It primarily increases concurrency by reducing memory pressure; speedups depend on kernel efficiency and dequantization overhead.
3. When does it help the most?
When KV cache memory is the bottleneck: long contexts, many concurrent requests, or limited GPU memory.
4. What quality regressions should I watch for?
Degraded long-range coherence, more repetition, or subtle factual errors on long-context tasks.
