Fine-tuning is the process of adapting a pretrained machine learning model to a specific task or domain by continuing training on task specific data, typically with a smaller learning rate and carefully chosen training objectives.

What is Fine-Tuning?

Modern AI systems often start from a foundation model that has learned general representations from large scale pretraining. Fine-tuning modifies the model so that it performs well on a narrower distribution, such as a company’s support tickets, medical notes, or codebase. In supervised fine-tuning, the training data contains input output pairs, for example a prompt and an ideal response. For LLMs, the objective is often next token prediction over formatted instruction data. Fine-tuning can also be done with preference based methods, such as RLHF, or with domain adaptation objectives that emphasize certain vocabulary and writing style. The key design choices include which layers to update, how to avoid overfitting, and how to preserve general capability while improving the target behavior. Evaluation should cover both task performance and regression tests for safety, factuality, and refusal behavior.

Where fine-tuning is used and why it matters

Fine-tuning is used to create domain specific assistants, improve structured output reliability, and adapt models to specialized terminology. It matters because prompt engineering alone can be brittle, while fine-tuning can make desired behavior consistent and scalable across many prompts. It also enables product teams to encode style guides and policies into the model’s responses, although governance is needed because fine-tuning can unintentionally introduce bias or reduce safety if the dataset is not curated.

1) Supervised fine-tuning (SFT): train on curated instruction demonstrations.
2) Continued pretraining: train on domain text with the original language modeling objective.
3) Preference and RL based fine-tuning: optimize using reward signals from human or automated feedback.

1. What is the difference between fine-tuning and training from scratch?
Fine-tuning starts from a pretrained model and adapts it, while training from scratch learns all representations from the beginning.

2. How much data do you need for fine-tuning an LLM?
It depends on the task, but high quality data can outperform large noisy datasets. Many teams start with a few thousand examples and iterate.

3. What are common risks of fine-tuning?
Overfitting, catastrophic forgetting, and encoding sensitive data into the model are common concerns.

4. Can fine-tuning reduce hallucinations?
It can, especially with domain specific ground truth examples, but it does not fully solve hallucinations without retrieval and verification.

5. Should you do fine-tuning or RAG?
RAG is better for up to date or private knowledge injection, while fine-tuning is better for behavior, style, and task patterns. Many systems use both.
