Retrieval-Augmented Generation (RAG)

An embedding model is a machine learning model that converts input data—most commonly text, but also images, audio, or code—into a fixed-length numeric vector (an embedding) that represents its meaning or features. These vectors are designed so that semantically similar inputs are close to each other in vector space, enabling fast similarity search, clustering, and retrieval.

What is Embedding Model?

In modern AI systems, embeddings act as a bridge between unstructured data and algorithms that operate on numbers. For text, an embedding model takes a sentence, paragraph, or document and produces a vector where distance metrics (cosine similarity, dot product, Euclidean distance) approximate semantic similarity. This is why embeddings power many Retrieval-Augmented Generation (RAG) pipelines: the system embeds documents and user queries, finds the nearest neighbors in a vector database, and retrieves the most relevant chunks for the LLM to use.

Embedding models are trained in several ways. A common approach is contrastive learning, where the model learns to place related pairs (query ↔ relevant passage, caption ↔ image) close together while pushing unrelated pairs apart. Some systems use supervised pairs; others use self-supervised data and hard-negative mining. The quality of an embedding model depends on factors like domain coverage, multilingual support, input length limits, and whether it supports symmetric tasks (text↔text) or asymmetric tasks (query↔document).

Because embeddings are used for ranking and retrieval, small differences can have large downstream effects. If an embedding model fails to capture domain-specific language, retrieval recall drops and the generator is forced to guess.

Where it’s used and why it matters

Embedding models are used in semantic search, recommendations, deduplication, anomaly detection, and RAG. They matter because they determine what information is “findable.” In RAG, an LLM’s factuality often depends more on embedding + retrieval quality than on the generator model. Operationally, teams evaluate embedding models with retrieval metrics, manage re-embedding when models change, and choose vector index settings to balance latency and recall.

  • Semantic search: “reset password policy” retrieves IT docs even if exact keywords differ.
  • RAG retrieval: Embed a user question and retrieve the top-k relevant chunks from a vector store.
  • Clustering: Group similar support tickets to discover recurring incident patterns.

FAQs

Are embeddings the same as tokens? No. Tokens are discrete pieces of text used as model inputs. Embeddings are continuous vectors representing meaning.

Do I need a separate embedding model if I already have an LLM? Often yes. Specialized embedding models are cheaper and optimized for retrieval, though some LLMs can also output embeddings.

How do you evaluate an embedding model for RAG? Use a labeled query-to-document set and measure Recall@k, MRR/nDCG, and end-to-end answer accuracy.

When should I re-embed my corpus? When you change embedding models, significantly change chunking, or when domain vocabulary shifts enough to affect retrieval quality.
